Bridging the “production gap”: from AI playground to profitability

AI must no longer be considered as an isolated experiment, but as a structural modernization program for the company.

The enterprise AI experimentation phase is coming to an end for many organizations. After a period marked by one-off uses via consumer web services, general management is now asking a simple question: what real economic value can AI generate?

Many of them, however, discover a gap between demonstration and production. A successful proof of concept does not automatically become a robust, enterprise-wide system. Especially since, as models become more commonplace, the real challenges shift to infrastructure, the software stack, security and the execution environment.

To transform AI into a lever for sustainable performance, companies must now apply the same requirements to it as for any critical application, in terms of governance, compliance, security and cost control. Three major transformations explain this shift.

The end of the myth of the “best model”

The first evolution concerns the place of the models themselves. During the first wave of generative AI, competition focused on raw model performance. But this advantage is now tending to erode.

Several dynamics are converging: rapid advances in specialized hardware for AI, an explosion of data available for training, and an acceleration of research into architectures and optimization techniques. Added to this is the rise of open source, which makes efficient models accessible in environments previously difficult to envisage, particularly on-premise or in contexts requiring strict data control.

Thus, the difference between models is quickly reduced. Above all, it does not always translate into tangible economic value. If a model improves the relevance of a chatbot by a few points but doubles the inference costs, the benefit to the company becomes questionable.

The real differentiation therefore shifts elsewhere: in the ability to optimize execution costs, integrate AI into business processes and govern these systems reliably.

In production, the most determining factors are no longer just the models but the technological stack: the hardware infrastructure, the choice of the right model for the right use, the cloud-native orchestration environment, or even inference optimization techniques. The value therefore no longer comes from the model alone, but from the architecture that surrounds it.

IT must learn to manage probabilistic systems

The second transformation is even deeper. Generative AI challenges a historic principle of enterprise IT: determinism. Traditional systems are based on explicit and predictable logic: identical input, identical output. Generative models, on the other hand, produce probabilistic, context-dependent results from large training data sets.

For IT teams, this involves a paradigm shift. The objective is no longer to guarantee an exact result for each request, but to regulate an acceptable level of reliability and to supervise possible deviations. Governance is therefore evolving towards a logic of risk management. Companies must learn to measure the quality of responses, robustness against prompt injection attacks, or even statistical drift of data.

Faced with this new situation, trust becomes a central issue. It is based on transparency, auditability of systems, traceability of models and the integration of human supervision mechanisms when necessary. AI must be thought of as a decision-making tool and an increase in human capabilities, not as an autonomous arbiter.

Interoperability as economic insurance

Finally, the third transformation concerns the economics of AI itself. Unlike traditional software, generative AI services are often based on usage-based billing. Costs are indexed to the volume of queries, the amount of data processed or the performance of the model. In a context of mass adoption, these costs can quickly become significant.

Some actors simultaneously control the model, infrastructure and orchestration tools. This vertical integration can create technological dependence that is difficult to reverse. AI thus amplifies the classic effects of technological lock-in: models can be optimized for specific hardware architectures, data enriched via embeddings or fine-tuning can become partially captive, and application integrations based on proprietary APIs make any migration complex.

An approach then gradually emerges, consisting of being able to use any model, on any architecture and on any cloud. This interoperability is based on open standards, containerization of workloads and cloud-native platforms capable of orchestrating hybrid or multi-cloud environments. Open source plays a central role here by providing portability, transparency that facilitates traceability and independence from suppliers.

The real challenge: industrializing AI

The gap between the discourse on AI and the reality of businesses remains significant today. The illusion of a “plug-and-play” AI, immediately generating productivity, comes up against the complexity of its industrialization. Between a prototype and a truly operational system, many infrastructure, data governance, security and compliance issues often remain underestimated.

The companies that will truly create value with AI in the coming years will be those that have understood that the issue goes far beyond the performance of the models. Their advantage will come from their ability to master technological architecture, optimize costs and integrate AI into concrete and measurable business processes.

For leaders, the decision to make is strategic. AI must no longer be considered as an isolated experiment, but as a structural modernization program for the company. This means investing as much in infrastructure as in open models, paying as much attention to governance as performance, and preserving interoperability and digital sovereignty.
